Etymology

1. c.1330, des, dys, pl. of dy (see die (n.)), altered 14c. to dyse, dyce, and 15c. to dice. "As in pence, the plural s retains its original breath sound, probably because these words were not felt as ordinary plurals, but as collective words" [OED]. Sometimes used as sing. 1400-1700. The v. "to cut into cubes" is first recorded c.1390. Dicey "doubtful, difficult" is RAF slang from the 1940s.

19. From Middle English dys, plural of dy. See the etymology of die (etymology 2) for further information. The voiceless /s/ was most likely retained because the word felt like a collective term rather than a plural form (compare pence), and the spelling dice is a result of the pronunciation.
